Purpose

Fixes #54658.

Render currently serializes the full MultiModalKwargsItem into features.kwargs_data. That blob mixes encoder tensors (pixel_values) with lightweight fields (image_grid_thw, video timestamps, other keep_on_cpu data). In E/P/D serving, encode already consumes pixel_values and publishes embeddings through the EC connector. Prefill then loads those embeddings with ec_transfer_params, but still receives the full kwargs_data because the protocol has no metadata sibling.

This PR adds a backward-compatible features.mm_metadata field:

  • Render still returns full kwargs_data (encode still needs it).
  • Render also returns mm_metadata: same per-modality item order, only placeholder_metadata_fields ∪ keep_on_cpu.
  • /inference/v1/generate accepts metadata-only features iff ec_transfer_params is set. Omitting both kwargs_data and EC params is rejected so generate-path encode cannot silently drop pixel_values.
  • Legacy clients that ignore mm_metadata and keep sending kwargs_data are unchanged.
Encode  = kwargs_data
Prefill = mm_metadata + ec_transfer_params
no EC / old clients = kwargs_data unchanged

llm-d is a control plane: it only forwards ec_transfer_params. The prefill vLLM worker pulls embeddings via the EC connector. This is the vLLM half of the coordinator optimization in llm-d-router docs/communication.md.

Why this is not duplicating an existing PR

I searched open issues/PRs for mm_metadata, kwargs_data, image_grid_thw, and "render multimodal metadata".

  • #43608 is an open draft from June that adds a Qwen-specific image_grid_thw JSON field on the old entrypoints/serve/disagg paths. This PR is generic (any placeholder_metadata_fields / keep_on_cpu field), uses the current scale_out protocol serde, and adds the EC-transfer guard.
  • #46722 is an RFC about deferring pixel_values out of Render. Complementary, not a substitute: encode still needs processed tensors; this PR only splits metadata so prefill can drop kwargs_data after EC transfer.
  • #51472 discusses renderer ownership of tensors. Related discussion, different scope.

Test Plan

.venv/bin/python -m pytest tests/entrypoints/scale_out/token_in_token_out/test_mm_serde.py -v
pre-commit run ruff-check --files \
  vllm/entrypoints/scale_out/token_in_token_out/mm_features.py \
  vllm/entrypoints/scale_out/token_in_token_out/protocol.py \
  vllm/entrypoints/scale_out/token_in_token_out/serving.py \
  vllm/entrypoints/scale_out/render/serving.py \
  vllm/entrypoints/scale_out/derender/serving.py \
  tests/entrypoints/scale_out/token_in_token_out/test_mm_serde.py

Test Result

  • Ruff / compile on the touched files: passed.
  • test_mm_serde.py (alignment, merge, metadata-only generate rejection, EC-params allow path): not run locally. The local .venv is Python 3.10 / broken Torch; CI should run this file.
  • No model-eval: this change does not alter generation, sampling, or model weights. It only adds an optional protocol field and a request validator.

Docs: docs/serving/online_serving/renderer.md documents mm_metadata and the encode vs prefill split.

AI assistance was used to draft the implementation, tests, docs, issue, and this PR. The submitting human reviewed every changed line.

Made with Cursor

Render currently ships full kwargs_data (including pixel_values) to every
downstream stage. Prefill only needs lightweight fields such as
image_grid_thw once embeddings arrive via the EC connector. Add
features.mm_metadata and reject metadata-only /generate unless
ec_transfer_params is set so E/P/D coordinators can drop the heavy blob.

As this becomes more complicated, I think we should set up e2e EC connector tests. Perhaps @NickLucche has more ideas on how to do that?

I think we need something like this #54973 but in a separate PR, because getting CI to comply usually requires a few iterations :)

Resolve MultiModalFeatures validator conflict: keep upstream's strict
_validate_parallel_fields and fold the new mm_metadata field into its
modality/length checks (mm_metadata must use the same modalities as
mm_hashes, and per-modality lengths must match).

Review Change Stack

📝 Summary

Summary by CodeRabbit

  • New Features

    • Added support for multimodal metadata in scale-out render responses, including modality ordering and metadata-only requests.
    • Improved handling of multimodal data across encode and prefill workflows, including cache hits and disaggregated processing.
    • Added validation for multimodal feature alignment and required transfer parameters.
  • Documentation

    • Added guidance and Python/JSON examples for multimodal render responses and compatibility with legacy clients.
  • Tests

    • Added comprehensive coverage for multimodal metadata extraction, merging, validation, and request handling.

Walkthrough

The change adds mm_metadata to multimodal render features. Shared helpers serialize and reconstruct full and metadata-only payloads. Generate validation supports metadata-only requests with EC transfer parameters. Render, derender, token serving, tests, and documentation use the new flow.

Changes

Multimodal metadata flow

Layer / File(s) Summary
Multimodal metadata protocol
vllm/entrypoints/scale_out/token_in_token_out/protocol.py
MultiModalFeatures now carries aligned mm_metadata. Validation checks modality and list-length alignment. Metadata-only requests require ec_transfer_params when kwargs_data is absent.
Feature extraction and reconstruction
vllm/entrypoints/scale_out/token_in_token_out/mm_features.py
Shared helpers serialize metadata fields, merge full and metadata-only items, extract features from engine inputs, and reconstruct multimodal kwargs.
Render and token serving integration
vllm/entrypoints/scale_out/render/serving.py, vllm/entrypoints/scale_out/derender/serving.py, vllm/entrypoints/scale_out/token_in_token_out/serving.py
Render and derender use shared extraction. Render obtains model-declared placeholder metadata fields. Token serving reconstructs kwargs through the shared helper.
Behavior validation and usage examples
tests/entrypoints/scale_out/token_in_token_out/test_mm_serde.py, docs/serving/online_serving/renderer.md
Tests cover metadata extraction, legacy payloads, EC validation, cache-hit slots, alignment, and merging. Documentation adds Python and JSON render, encode, and prefill examples.

Estimated code review effort: 4 (Complex) | ~45 minutes

Merge Risk: 🟠 High · up to 8934d

Mixed-modality rendering can fail validation, while partially metadata-only generation requests can reach inference without the EC connector required to supply encoder data. These paths should be fixed before merge.

🗄️ Data Integrity & Integration | 🟠 Major | ⚡ Quick win

Preserve metadata slots for all modalities.

When one modality has metadata and another modality has no declared or keep_on_cpu fields, Lines 87-88 omit the latter modality. Line 90 then returns a non-empty partial mapping.

MultiModalFeatures rejects that mapping because mm_metadata must use the same modality keys as mm_hashes. Keep the all-None list for every modality whenever any modality has metadata. Add an image-plus-audio regression test.

🎯 Functional Correctness | 🟠 Major | ⚡ Quick win

Validate metadata-only data for each item.

Line 195 accepts the request when any kwargs_data item is serialized. A request can then contain full data for one item and a metadata-only entry for another item without ec_transfer_params.

Require ec_transfer_params when any non-None mm_metadata entry has no matching serialized kwargs_data entry.
